Synthetic Evaluation Data: Avoid Contamination and Privacy Leakage

Synthetic questions make test suites easier to scale, but a synthetic benchmark can leak source records or reward a model for learning the generator’s habits rather than the real task.

Identify the test purpose

Use synthetic samples to stress known patterns such as date ambiguity, missing fields or unusually long documents. For real-world validity, keep separate, appropriately consented and secured representative cases. A synthetic dataset is not automatically nonpersonal just because its output text was generated.

Guard against prompt and answer contamination

Do not publish held-out test answers into developer prompts, retrieval indices or training corpora. Version generators, generation instructions, answer keys and split boundaries. Use exact-match and semantic near-duplicate detection against known development data, especially after repeated model tuning.

Audit privacy risk

Source prompts might contain real addresses, clinical cases or proprietary statements that survive paraphrasing. Before release, test for close reproductions, sensitive combinations and inferability. Where necessary, use formal privacy protection methods and independent risk testing rather than assuming a made-up name makes a record anonymous.

Measure the mismatch

Compare failure patterns between human-created and synthetic cases: length, writing register, topical concentration and refusal frequencies. If scores diverge, report the gap and avoid extrapolating a synthetic score to live user reliability. The NIST adversarial ML taxonomy provides useful language for data poisoning and leakage threats.

Example

A bank tests ambiguous date formatting by generating hundreds of mock statements. Reviewers ensure no customer facts entered prompts, and preserve an untouched human-reviewed set for final evaluation. The model is assessed against both groups; the synthetic cases are reported as stress tests, not market-wide evidence.
